Layer Types

Beyond Dense Layers
  • So far, we’ve used dense layers where every neuron gets input from all activations of the previous layer
  • Dense layers can build powerful learning algorithms
  • However, other layer types exist with different properties and advantages
Alternative Architecture
  • In convolutional layers, neurons look at only a limited region of the input
  • Example: For image inputs, each neuron might only look at a small rectangular region of pixels

Computational Efficiency

  • Speeds up computation
  • Reduces number of parameters
  • Faster training and inference

Better Generalization

  • Needs less training data
  • Less prone to overfitting
  • More efficient use of data patterns

1D Example
  • Electrocardiogram (ECG/EKG) signals show voltage patterns of heartbeats
  • Can be represented as a time series (e.g., 100 numbers showing signal height at different times)
  • Task: Classify whether patient has heart disease
  1. Input Layer:
  • 100 inputs (X₁ through X₁₀₀) representing the ECG signal
  1. First Convolutional Layer:
  • Each unit looks at a small window of the input
  • First unit: examines X₁-X₂₀ (first window of ECG)
  • Second unit: examines X₁₁-X₃₀ (second window)
  • And so on with overlapping windows
  • Total of 9 units in this example
  1. Second Convolutional Layer:
  • Units also look at limited windows from previous layer
  • First unit: examines only first 5 activations from previous layer
  • Second unit: examines activations 3-7
  • Third unit: examines activations 5-9
  1. Output Layer:
  • Uses sigmoid activation
  • Looks at all three values from second hidden layer
  • Makes binary classification for heart disease

  • Current neural network research focuses on:

  • Inventing new types of layers

  • Combining different layer types as building blocks

  • Creating more complex and powerful architectures

While dense layers form the foundation of neural networks, specialized layer types like convolutional layers offer significant advantages for certain applications. By restricting each neuron to process only a portion of the previous layer’s outputs, convolutional layers can improve computational efficiency and generalization ability. This concept of specialized architecture has led to numerous innovations in neural network design, driving modern advances in deep learning.
